vLLM Investigation - Final Verdict

Executive Summary

After exhaustive testing, vLLM cannot run on your current GPU hardware with any model configuration that would be practical. The fundamental issue is GPU memory capacity - even the smallest viable models (3B parameters) require more memory than available after accounting for Docker and vLLM overhead.

Recommendation: Keep Ollama as the local inference engine. It works, saves $225/month vs all-cloud, and fits within hardware constraints.

What We Tried (Chronological)

1. Python venv Installation (Failed - Compilation Issues)

  • vLLM 0.23.0 via pip
  • Model: Qwen2.5-7B-Instruct-AWQ (5.2GB)
  • Blocker: FlashInfer JIT compilation failures
    • Missing ninja build tool → installed ✓

    • Docker overhead: ~2GB
    • Result: 6GB usable < 8.2GB needed

4. Docker Official Image - 7B AWQ Reduced Context (Failed - Still OOM)

  • Config: 2K context, 95% GPU util
  • Error: The model's max seq len (2048) is larger than the maximum number of tokens that can be stored in KV cache (784)
  • Result: Can only fit 784 tokens in KV cache (unusable)

5. Docker Official Image - 3B Full Precision (Failed - OOM)

  • Model: Qwen2.5-3B-Instruct (6GB)
  • Config: Single GPU, 8K context, 90% GPU util
  • Error: No available memory for the cache blocks
  • Result: Even smaller model + full precision still OOMs

6. Docker Official Image - 3B Reduced Context (Failed - OOM)

  • Config: 4K context, 95% GPU util
  • Error: Same memory error
  • Result: vLLM’s memory calculation too conservative for Docker environment

7. Docker Official Image - 3B Tensor Parallel (Failed - GPU Imbalance OOM)

  • Config: tensor-parallel-size=2 (both GPUs), 8K context, 90% util
  • Stopped Ollama to free GPU 0
  • Error: torch.OutOfMemoryError: CUDA out of memory on GPU 1
    • GPU 0 (6GB): 5.01GB in use
    • GPU 1 (8GB after Docker overhead → 5.67GB effective): 5.01GB in use + tried to allocate 2MB
  • Result: Unbalanced GPU sizes cause one to OOM during tensor-parallel operations

Root Causes

Primary Issue: GPU Memory Insufficient

  • Docker overhead: ~2GB per GPU
  • vLLM overhead: Model + KV cache + PyTorch pools + CUDA graphs
  • Your hardware: 6GB + 8GB = 14GB total, but Docker makes it 4GB + 6GB effective
  • Minimum needed: 7B model needs ~10GB, 3B model needs ~8GB with reasonable KV cache

Secondary Issue: Mismatched GPU Sizes
